Abstract

This research presents an innovative intelligent technology platform that integrates artificial intelligence and advanced deep learning methodologies to revolutionize industrial machinery health monitoring and predictive maintenance. Bearing failures represent a critical challenge in modern manufacturing, accounting for 45% of machinery breakdowns worldwide. Traditional diagnostic approaches rely on manual feature engineering and are labor-intensive, creating significant operational and economic challenges. This work addresses these limitations through cutting-edge deep learning technology.

We propose a sophisticated hybrid technology architecture that seamlessly integrates Convolutional Neural Networks (CNN), Long Short-Term Memory (LSTM) networks, and attention mechanisms. This technological integration enables fully automated fault detection and classification from raw vibration sensor data. The CNN technology extracts hierarchical spatial features through learnable filters, while LSTM technology captures temporal dependencies and degradation patterns. An innovative attention mechanism selectively focuses computational resources on critical fault-indicative patterns, significantly enhancing both diagnostic accuracy and system interpretability. The complete technology stack comprises 868,000 trainable parameters organized into intelligent feature extraction (64 and 128 CNN filters), advanced temporal modeling (256 and 128 LSTM units), adaptive attention weighting, and precision classification layers.

Comprehensive experimental validation demonstrates exceptional performance: 98.7% classification accuracy across ten fault categories, outperforming traditional machine learning (SVM: 85.3%, Random Forest: 88.7%) and standalone deep learning approaches (CNN-only: 94.5%, LSTM-only: 92.8%) by significant margins. The technology maintains robust performance across varying industrial operating loads (0-3 HP) and motor speeds (1730-1797 RPM) with less than 1% accuracy degradation. Real-time processing capability achieves 16.8 ms inference time per sample, enabling practical industrial deployment.

This intelligent technology solution achieves state-of-the-art performance while maintaining real-time processing capability, making it ideally suited for industrial automation systems within Industry 4.0 environments. The technology eliminates manual feature engineering, provides interpretable AI-driven diagnostics, and demonstrates excellent generalization across diverse operational conditions, representing a significant technological advancement for intelligent machinery monitoring and digital transformation in manufacturing.
